Daniel Baier also came close to scoring as his right-footed effort missed by a whisker, before Alexander Esswein's volley went marginally wide.
However, they were punished later in the half as Raffael Araujo capitalised on some poor goalkeeping to tap the ball in.
Monchengladbach were reduced to 10 men just after the hour mark as Havard Nordtveit was shown a straight red card for bringing down an attacker who was clean through on goal.
Augsburg made them pay as Pierre Hojbjerg equalised with a powerful long-range strike that flew into the top corner, before Tim Matavz powered a header past the keeper five minutes later.
They wrapped up the win in added time as Sascha Molders found the top corner with a bullet from outside the box.
